Example of Quadratic Regression Using the scikit-learn Library

Quadratic regression is an interesting technique that used to be very common but isn’t used as often as it used to be. Suppose you have three predictor variables, x0, x1, x2. The form of a basic linear regression model is y’ = (w0 * x0) + (w1 * x1) + (w2 * x2) + b. The wi are the model weights and the b is the model bias.

In quadratic regression, you’d have:

y’ = (w0 * x0) + (w1 * x1) + (w2 * x2) +
(w3 * x0 * x0) + (w4 * x1 * x1) + (w5 * x2 * x2) +
(w6 * x0 * x1) + (w7 * x0 * x2) + (w8 * x1 * x2) +
b

You add each predictor squared as a new predictor, and you add all combinations of pairs of predictors multiplied together as interaction effects. If you have n predictors, a quadratic regression model has n base terms, n squared quadratic terms, and (n * (n-1)) / 2 interaction terms.

After you create the augmented quadratic and interaction predictors, you apply standard linear regression. Quadratic regression can deal with complex data that has interactions between predictor variables. Quadratic regression with x^2 terms is a subset of polynomial regression where you can add x^3 or x^4 and so on.

To test my knowledge of quadratic regression, I put together a demo using the scikit-learn library. For my demo, I used one of my standard synthetic datasets. The data looks like:

The first five values on each line are predictors, the last value on a line is the target value to predict. There are 200 training items and 40 test items.

Because there are 5 predictors, there are 5 base terms, 5 squared terms, and (5 * 4) / 2 = 10 interaction terms, for a total of 20 predictors per item.

If you look closely, you can see that the scikit PolynomialFeatures object generates the squared features and the interactions terms in an unusual order.

I don’t really like the scikit approach to quadratic regression — it’s just preliminary data manipulation, then linear regression. I’d have preferred an integrated architecture that would resemble:

Hmm, I guess I could write a QuadraticRegressor wrapper class to encapsulate quadratic regression. But that will have to wait for another day.

The scikit approach allows cubic (x^3) or quartic (x^4) or quintic (x^5) or any polynomial. But anything beyond quadratic is very rare, because the number of derived variables becomes every large, very quickly.

An interesting experiment.



Quadratic regression was one step forward in the evolution of machine learning techniques. I find the history of pinball machines very interesting. The “Rockettes” (1950) machine by Gottlieb had the first modern flipper geometry. The “Humpty Dumpty” (1947) machine by Gottlieb had the very first flippers but they swung in the opposite direction of modern geometry. “Rockettes” didn’t have reel scoring, or in-lanes on the side, or drop targets — features that would be added later.
