Random Neighborhoods Regression Using C#

I woke up one morning with a mild cold and headache. The headache wasn’t too bad, but it was bad enough that I didn’t want to work on difficult topics like PyTorch neural systems or simulated quantum computing. So I figured I’d take a stab at an algorithm idea that had been floating around in my head for several weeks — random neighborhood regression. Briefly the idea is to create an ensemble collection of k-nearest neighbor regressors.

The idea of random neighborhood regression was inspired by random forest regression, where, to make a prediction, you construct many simple decision tree regressors and return the average of the predictions.

Basic k-nearest neighbors regression is simple. To predict the y value for an input vector x, you find the k-nearest training items to x (the value of k is typically between 2 and 7) and return the average of the associated known target y values in the training data.

Two problems with basic k-nearest neighbors regression are 1.) you must use trial and error to find a good value for k, and 2.) the trained model often overfits the training data and so the model predicts the training data well but predicts poorly on new, previously unseen data.

The idea of random neighborhoods regression is to create a virtual collection of k-NN regressors, where each regressor uses a subset of the full training data (perhaps like 90% of the rows) to limit overfitting, and a randomly selected k (number of nearest neighbors) within some range (perhaps 2 to 7) to avoid having to use trial and error to find a good k.

I put together a demo of random neighborhoods regression using C#. I was quite pleased with the results. For my demo, I used one of my standard synthetic datasets that looks like:

The first five values on each line are the x predictors, and the last value on each line is the target y value to predict. The data was generated by a 5-10-1 neural network with random weight and bias values, so the data has a underlying structure and therefore can be predicted. There are 200 training items and 40 test items.

Each of the predictor values is between -1 and +1. When using k-nearest neighbors, it’s important to use normalized data because the closest items are measured using Euclidean distance. If data isn’t normalized, a column with large magnitude values will overwhelm column(s) with small magnitude values when distance is computed.

A prediction is scored as correct if it’s within 15% of the true target value. Notice that the system doesn’t eliminate the need to find good parameter values (numNeighborhoods, pctData, minK, maxK) but you could supply sensible default values if you wanted to.

Oh well. The random neighborhoods regression algorithm isn’t a major advance in machine learning, but I’m happy that I came up with an interesting (to me anyway) idea to create a regression model and was able to implement it.



One of my most cherished Christmas gifts was my first model train set, shown on the left. It was made by American Flyer in 1956 and was “S” size — smaller than the common Lionel “O” but not as small as the more adult “HO” scale. I acquired more track sections and switch tracks and added them to the basic set. I was fascinated by the geometries of different layouts.

I suspect that people like us (meaning you and me if you’re reading this blog post) have a built-in predisposition towards fascination with models. There are a lot of research studies that show boys have a greater interest in mechanical toys and construction sets. Girls tend to gravitate towards nurturing toys like dolls. These preferences are attributed to biological differences in brain development that influence spatial reasoning.
